perf(pt): fuse the mixing-stack per-layer backward chain (opt-in) - #6060
long-yi-2019 wants to merge 7 commits into
Conversation
…D_FUSED_INFER) Each gated layer's backward runs as recompute -> pointwise -> GEMM, materializing the sigmoid surface and the pre-activation gradient to HBM and reading both straight back. With the flag on (and the supported regime: fp32, narrow channels, no higher-order graph), one kernel walks the chain with both surfaces in registers, matching the relay bit-for-bit; the m = 0 and |m| = 1 column segments launch separately to keep the lighter segment off the heavy one's register profile. The 2.15 GB standing scratch never allocates; on the N=4096 eval workload it does not coincide with the frame's peak.

Reviewed the three-file delta from dbca0b1 to 4455e67, including the existing recompute/pointwise/GEMM implementations, launch configuration lookup, autograd routing, and new tests. One nonblocking regression-test issue is noted inline; source inspection did not establish a production kernel correctness defect.
Validation: eight isolated checks of the exact-source environment parser passed. Repository tests and CUDA/Triton numerical or compilation checks were not run: this executor has neither PyTorch nor Triton. The author-reported CUDA results were not independently reproduced. At review time all seven PR-triggered Actions runs reported action_required (the CUDA run has no jobs); pre-commit passed and Read the Docs reported failure. No CI runs were activated or rerun.

[P3] Enable fusion before asserting that unsupported inputs fall back
This test and test_wide_channels_fall_back never set DP_STACK_BWD_FUSED_INFER, and _record_launches does not set it either. In the normal default-off test run, fused short-circuits at use_stack_bwd_fused(), so these assertions pass without exercising the unsupported-dtype/channel dispatch contract. In particular, removing the fp32 guard would still leave this bf16 regression test green. Please scope both calls with mock.patch.dict(os.environ, {"DP_STACK_BWD_FUSED_INFER": "1"}) (or equivalent) so the tests actually request the feature they expect to reject.

@OutisLi @wanghan-iapcm @njzjz requesting a review, please. Following the 2026-10-13 discussion we validated the combined stack of our six performance PRs (#6056, #6057, #6060, #6070, #6071, #6072) with a multi-scale gate: diamond + bcc-Cu at ~500 / ~2000 / ~4400 atoms, three columns (pure torch.compile with all custom kernels off / current master / our changes on). All accuracy cells sit within 2.2x the pure baseline's own run-to-run band (criterion: 3x), and no tested atom count regresses in time or memory — full numbers in the PR descriptions. Suggested review order for the six: #6056 -> #6057 -> #6060 (small and self-contained) -> #6070 -> #6071 -> #6072. |

I reviewed the exact head. The existing test-contract finding at source/tests/pt/model/test_descriptor_sezm_triton.py:2272 remains valid: the fallback tests never enable DP_STACK_BWD_FUSED_INFER, so they can pass without exercising the unsupported-input guards. Please scope the tests with the flag enabled and rerun the failing documentation check.

This PR removes intermediate sigmoid/pre-activation-gradient surfaces from the fp32 mixing-stack backward by recomputing them inside the matrix-multiply kernels. The optimization has a real use case, but the public control, tuning integration, duplicated mathematics, and test cost need changes before merge.
Changes required
-
Use the existing inference levels; remove the new environment variable.
DP_STACK_BWD_FUSED_INFERis a fine-grained development switch and should not become a public interface. Do not replace it with another switch or introduce another level. This optimization belongs within the existingDP_TRITON_INFER >= 2value-path selection: level 2 already covers table-tuned kernels, while level 3 adds validated fp16x3 arithmetic. Keep supported-shape and profitability decisions internal. See the new selector and the existing level contract. -
Integrate the optimization into freeze-time autotuning, rather than shipping one fixed launch configuration.
Extend the existingsweep_tile_configs.pymachinery and its registration/lookup path so thatfreeze_pt2._tune_triton_configs()can discover and tune the new choice before tracing. A standalone benchmark that freeze never invokes is not sufficient. Compare numerically valid fused candidates against the current optimized relay, select the fastest valid candidate among those evaluated, and retain the existing path when fusion does not win. Record that outcome so repeated tuning does not redo completed work. Existing coverage for the old GEMM family must not incorrectly imply coverage for this new choice. See the fixed configuration, the sweep registry, and the freeze hook. Please provide results from running the added autotuner on your own available hardware: GPU/software versions, tested shapes, selected configurations or fallback, numerical agreement, and timings against the existing path. You are not required to populate the existing built-in configuration tables for hardware you do not have. The automatic tuning integration and evidence from hardware you can actually test are required.
The need for selection is measurable. On an RTX PRO 6000 Blackwell Server Edition with PyTorch 2.13.0+cu130 / Triton 3.7.1, the same synthetic fp32 backward workload (
E=300003, Cf=32, F=2, three gated layers plus the final linear layer, alpha enabled) gave:lmax Existing path Fused path Time change 3 11.58 ms 10.49 ms -9.4% 6 26.82 ms 45.39 ms +69.3% These are backward-operator microbenchmarks, not whole-model timings: identical inputs, CUDA-graph timing, off/on/on/off order, and the average of two median measurements per state. Outputs were bitwise equal. The degree-6 fused binaries also reached 255 registers with
n_spills=68–92; the fixed configuration does not universally avoid spills. -
Consolidate the duplicated derivative implementation.
The new kernel repeats the existing SiLU/gate derivative and scalar-gradient accumulation while requiring bitwise agreement. Shared mathematics and control flow should have one implementation wherever they can be unified; keep only genuinely different execution schedules separate. Small inlined Triton helpers are one option, subject to numerical and performance validation. Avoidable duplication is a maintainability issue to fix, not optional polish, and replacing it with a wrapper-heavy framework would not address that issue. See the duplicated chain. -
Reduce redundant test work and keep ordinary GPU CI inexpensive.
Remove the new environment-parser tests along with the switch, and extend existing level/configuration-selection tests instead. The dispatch-only cases need not all allocate the shared 20,000-edge fixture. Use small representative inputs for numerical checks where they still exercise the intended kernel and tile boundaries; reuse existing higher-order/compile coverage rather than adding another heavy suite. Keep production-scale benchmarks in the tuning/benchmark workflow, not ordinary GPU CI.Do not mechanically shrink the higher-order case: its current
2 * 20000 * 320 * 4-byte surface is just above the existing 48 MiB traversal threshold, so a smaller fixture changes the branch exercised. Preserve the intended coverage explicitly when reducing cost. See the fixture and the threshold.
Verification
Seven targeted tests passed, including 15 subtests and the SO2Convolution integration comparison. Additional off/on probes across 11 shape cases were bitwise equal; the first-order autograd and symbolic FX-to-Inductor checks also agreed bitwise, with fused dispatch confirmed. Ruff and diff whitespace checks passed. No numerical correctness defect was established within this coverage; the author's whole-model 1.7% result was not independently reproduced.
The earlier comment about fallback tests failing to enable the switch has been addressed in this head and is not being raised again. The requested changes above concern the architecture and acceptance criteria of the optimization, not that already-fixed test issue.

Replace the standalone DP_STACK_BWD_FUSED_INFER switch with the existing DP_TRITON_INFER >= 2 value-path selection: the fused per-layer backward engages only where the freeze-time sweep measured it as the winner for the (focus_dim, lmax) shape, through the new stack_bwd_fused tile-config family. The sweep drives the real backward traversal, accepts a candidate only on bitwise agreement with the relay, and records None (the relay) when fusion does not win by at least 2%; an untuned environment therefore never leaves the unfused relay. The SiLU and sigmoid cotangent chains the fused kernel repeated from the pointwise kernels now live in shared inlined Triton helpers with an identical instruction tree (bitwise agreement re-verified).

Thank you for the depth of this review — the lmax=6 counter-example in particular settled the architecture question. All four requested changes are implemented in 66f3b720 + 2c43bd1c (rebased on the master merge): 1. Environment variable removed, routed through the existing levels. 2. Freeze-time autotuning instead of a fixed configuration. New Your hardware evidence, requested in kind (RTX 5090, torch 2.12.1+cu130, Triton as shipped; traversal microbenchmark, three gated layers + final linear, alpha on, saturating edge count, mean of 50 iters; all candidates bitwise-equal to the relay on every shape):
So on this GPU the fused kernel is neutral-to-slower everywhere tested — including your lmax=6 counter-example shape, where it does not catastrophically regress as on the RTX PRO 6000 but does not win either — and the tuner keeps the relay everywhere. At the production edge count (648k) the (32, 3) picture is unchanged (27.69 vs 27.70 ms, relay). The whole-model frame at N=4096 with the new code is 153.40 ms vs 153.04 on master — parity, as intended for an untuned environment. I am correspondingly withdrawing the earlier 1.7% whole-model claim: it was measured with forced engagement, and on hardware where the sweep selects the fused kernel the gain will be whatever that hardware's sweep measures (on yours, the −9.4% you measured at lmax=3). No built-in table entries were added for hardware we do not have. 3. Duplicated derivative math consolidated. The SiLU cotangent ( 4. Test cost reduced. The environment-parser class is deleted with the switch. The numerical fixture keeps its 20k-edge size (kernel and tile boundaries); dispatch-only checks ( Validation: full |

Re-measure the relay between candidates, or rotate the order over several rounds and use the median, as

The public switch removal and table-driven fallback are present, but the new candidate benchmark does not measure fusion in the ordinary tuning context; details inline.
Validation used the exact sweep function, _bench, and production eligibility expression with host doubles: 6 fused correctness calls were followed by 318 relay-only candidate warmup/timing calls. An outer no-grad control produced 324 fused candidate calls. These counts establish host routing only; timing values were simulated and no GPU performance or numerical-kernel claim is made.
The retargeted numerical comparison also registers a winning entry without enabling a level that selects it; at the default level 0, its six calls use the relay. Please make the tuning/test setup assert the intended production dispatch. I am not reopening a duplicate of the existing fallback-selector thread or the earlier architectural requests.

[P2] Benchmark each fused candidate inside the no-grad context
The with torch.no_grad() scope ends after the correctness call, so this _bench(run_traversal, ...) executes with the caller's grad mode. _bench does not change it, while _stack_backward_traversal requires not torch.is_grad_enabled() before selecting stack_bwd_fused_cfg (so2_value_path.py:3572–3587). The normal freeze-time tuning call is grad-enabled. It therefore validates the fused candidate once but times the relay for every candidate, making the 2% winner test relay-versus-relay. Real fused wins can be discarded, and timing noise can register a candidate whose performance was never measured.
An exact-source host-control-flow replay at level 2 observed all 318 candidate warmup/timing calls selecting the relay; wrapping the same sweep in no-grad made all 324 candidate validation/timing calls select fusion. Keep the candidate benchmark in the same no-grad context as its correctness check and add a dispatch-sensitive regression for the timed calls. This is a routing reproduction with doubles, not a GPU benchmark.
…ection in tests The candidate benchmark ran outside the no_grad context, so the traversal's is-grad-enabled guard routed every timed call to the relay: the sweep compared relay against relay. Both the correctness call and the timing now run under no_grad. The retargeted tests ran at whatever the ambient Triton level was; at the default level 0 both table states take the relay and the comparison goes vacuous. The class now sets level 2 itself (the dispatch matrix test manages its own levels), and the bitwise test counts the fused launches -- 0 with a None entry, one per gated layer with a winning entry -- so output equality alone can no longer pass.

Both findings confirmed and fixed in 2e8e6f3 — and the timing fix materially changes the evidence I posted yesterday, so this comment supersedes that table. 1. Candidate benchmark ran outside Corrected RTX 5090 evidence (same setup as before: torch 2.12.1+cu130, traversal microbenchmark, three gated layers + final linear, alpha on, saturating edges, mean of 50 iters, all candidates bitwise-equal to the relay):
So the true 5090 picture is the same shape as your RTX PRO 6000 data — substantial fused wins at low degrees, a severe regression at degree 6 — which the broken timing had flattened into "the relay wins everywhere". The per-shape tuner selection was necessary from the start; yesterday's "neutral on 5090" statement and the whole-model parity number were artifacts of the broken comparison and are withdrawn. 2. Tests went vacuous at the ambient level. Correct as well — my local runs happened to carry |

These changes address both findings. I did not rerun the GPU tests or reproduce the timings. Your corrected traversal measurements support per-shape selection: fusion wins at low degrees, while the relay avoids the measured regressions at degrees 4 and 6. These measurements do not establish a whole-model speedup. ✏️ Learnings added

Scoped fix verification at exact head 2e8e6f331889f0b8f6bb2af512d2694e8141ba73.
The two issues described in my earlier review at 8476318c are fixed in this two-file delta: candidate correctness and timing now both run under torch.no_grad(), and the numerical/fallback tests pin inference level 2 and observe the real launcher. Exact-source host replay changes the old six fused correctness calls plus 318 relay-only candidate warmup/timing calls into 324 fused-selected candidate calls, with 54 relay baseline calls. Sixteen test-method checks across absent/0/1/3 ambient levels pass; a negative control that suppresses launches while retaining equal outputs fails all three numerical subtests.
These are host-routing and assertion checks using doubles, not local GPU, numerical-parity, or performance runs. The corrected RTX 5090 timings and withdrawal of the earlier neutral/whole-model evidence are the author's results. Current-head CI awaits approval (action_required). This acknowledges the specific fixes without replacing the requested human re-review or asserting whole-PR approval. The previously noted direct/manual level-0 tuning caveat is unchanged and is not reposted as a new finding.

This PR fuses the per-layer backward relay of the SeZM mixing stack (gate-sigmoid recompute, pointwise backward writing gz, transposed-weight GEMM reading it back) into a single Triton kernel that keeps the sigmoids and the gz tile in registers, launched as two passes per layer over the m=0 block and the |m|=1 stripes, with the relay's tiling and tl.dot order so fp32 results stay bitwise identical. Dispatch is gated on DP_TRITON_INFER>=2, a freeze-time-tuned stack_bwd_fused table entry, and the shape/grad-mode conditions; untuned environments keep the relay.
Blocking: the PR description no longer matches the code at 2e8e6f3. It still documents an opt-in DP_STACK_BWD_FUSED_INFER env flag (default OFF), use_stack_bwd_fused(), a CPU TestSeZMStackBwdFlagParser, a "shipped 32/64 config" and a "this PR (flag on)" benchmark row. None of these exist at HEAD (the flag was removed in fa5e98e): the fused path now engages only at DP_TRITON_INFER>=2 with a tuned table entry, and no built-in entries ship. Since the description becomes the squash commit message, please rewrite it (and the "(opt-in)" wording in the title) to describe the actual gating, and re-state the measurement in terms of the current mechanism (tuned entry present vs. absent).
Three non-blocking items inline. Note also that every substantive workflow on this head is still at action_required, and the new tests are CUDA-only, so they only run in the Test CUDA job.

Non-blocking: sweep_stack_bwd_fused drives _stack_backward_traversal, whose fused gate reads the Triton level at call time (so2_value_path.py:3575, max(triton_infer_level(), triton_train_level()) >= 2). Neither this function nor main() sets or asserts that level (--level only reaches tune_missing_configs). A manual CLI run without DP_TRITON_INFER>=2 exported therefore times relay vs. relay: the torch.equal check passes trivially and a >2% timing-noise "winner" gets registered and printed into the tile_config_data fragment. The freeze path is fine because it runs at the model's level, but the standalone sweep is not. Could you set/restore the level inside the sweep (or assert triton_infer_level() >= 2), and ideally assert that the fused launch actually happened for each candidate, e.g. by counting _launch_stack_bwd_fused calls as the tests already do?

Non-blocking: _run_traversal hard-codes with_weights=False, keep=False, no upstream z cotangent, and the tests only use Cf=32, so with a winning entry registered the false side of several dispatch guards in _stack_backward_traversal is never exercised: focus_dim != block_k, non-power-of-two Cf (e.g. 48), with_weights=True, keep=True, grad_z_upstream is not None. Each of these protects the bitwise-matching assumption of the fused kernel, so a regression in any of them would silently route to it. Could you parametrise the traversal call over these arguments (with the winning entry registered) and assert zero fused launches?

The optimization still has a meaningful purpose: removing the sigmoid/pre-activation-gradient memory round trips from the per-layer backward. The public micro-switch is removed, the new configuration family participates in the PT freeze sweep, candidate timing is now inside no_grad, and the numerical tests pin the level and observe fused engagement. Those fixes are acknowledged and are not being raised again. The corrected RTX 5090 results in the author's follow-up are useful evidence for shape-dependent selection, not measurements independently reproduced in this round.
1. [P2] Connect the SeZM tuner to the PT-expt freeze path
PT freeze invokes _tune_triton_configs(), but PT-expt export calls the separate registered-autotuner mechanism. At this head, only dpa1_edge_conv and dpa1_se_conv register there; no SeZM tuner is registered. There are no built-in stack_bwd_fused winners either. Consequently, a normal PT-expt freeze in a fresh process without manually pre-populated runtime configurations never tunes this choice and keeps the relay.
A CPU routing check constructed supported PT and PT-expt SO2 convolutions, collected the same (32, 3, 2, 1) shape key from both, and exercised the respective tuning entry points with device predicates mocked: PT called the SeZM sweep once, PT-expt zero times, and the fused key remained uncovered. This is an entry-point/registration check, not a CUDA export.
Register the SeZM tuning flow in the existing shared mechanism and make both freeze paths use it consistently, including any required post-tuning rebinding. Sharing the execution kernel alone does not provide dual-backend delivery when one backend never supplies its winning configuration. Avoid copying another PT-specific freeze implementation into PT-expt.
2. [P2] Ensure a manual sweep actually measures the fused candidate
The candidate sweep does not establish or validate the execution level, while the production predicate reads ambient DP_TRITON_INFER/DP_TRITON_TRAIN. The CLI's --level argument does not set those selectors. With both ambient levels at their default zero, candidate correctness and timing calls select the relay.
Exact-source sweep/control-flow replay observed all six candidate timing calls selecting the relay at level 0, versus all six selecting fusion at level 2. Scripted benchmark return values were sufficient to make the level-0 sweep register a fused winner despite never selecting fusion. These values were injected to demonstrate the registration error; they are not GPU timings.
Make the requested tuning policy agree with the actual execution policy, and verify candidate engagement before treating correctness/timing results as fused results. Reject a misconfigured sweep before benchmarking, or establish the intended policy through the existing mechanism; do not introduce another public switch. This confirms the existing manual-sweep comment, rather than opening a duplicate inline thread.
3. [P2] Do not record unexpected candidate failures as a completed relay win
The catch-all candidate handler continues after arbitrary exceptions, then registers None if no candidate survives. An explicit None is considered covered and subsequent automatic tuning skips that key.
Injecting an internal AssertionError for each fused candidate, while keeping the baseline operational, makes the sweep return normally with None and mark the key covered. The rejection messages are printed, but the resulting state still says that tuning completed and the relay won. An implementation failure is not a measured profitability result.
Handle known non-launchable/resource-limited candidates explicitly. Unexpected internal errors must remain failures or leave the key uncovered instead of becoming a successful cached sweep outcome. Keep the legitimate fallback for numerically invalid or genuinely slower candidates.
Remaining design, measurement, and coverage requirements
- Complete the derivative consolidation. The common SiLU helper is an improvement, but the training branch still spells out the sigmoid cotangent already represented by
_sigmoid_bwd. Use the shared mathematical definitions where the contracts are identical, while retaining genuinely different memory/execution schedules. A large wrapper framework is not needed. - Compare candidates against interleaved/repeated relay measurements. The new sweep times the relay once first and then all candidates sequentially; a 2% margin alone does not remove directional clock/thermal/cache drift. Follow the existing repeat/rotating-order selection pattern instead of introducing a weaker independent measurement procedure.
- Keep ordinary numerical cases small and include a partial tile, for example 129 edges. The direct first-order traversal comparison does not need the 20,000-edge fixture; both 20,000 and the 512-edge dispatch fixture are multiples of the current BLOCK_M=32. Add lightweight guard checks for weight/state/upstream-cotangent and reduction-width restrictions with a winning entry present. Preserve the higher-order test's intended branch: its existing surface is just above the 48 MiB threshold, so do not mechanically shrink that separate case without preserving its coverage.
- Rewrite the title/body to describe the actual mechanism and current evidence. They still describe the deleted environment flag/parser and fixed configuration, and retain the withdrawn 1.7% whole-model claim. The corrected author comment must be integrated into the maintained description, not left as a contradictory addendum. This also agrees with the existing human review. Update source comments that still describe a universally fixed M=32 launch when the tuner evaluates other dimensions.
The required fix is a coherent tuning and deployment path shared by both backends, with trustworthy candidate selection and proportionate regression coverage. The corrected author-hardware evidence does not need to be expanded into tables for GPUs the author cannot access, and this review does not request another production-size CI benchmark.
Verification and limits
- Three small actual Triton-interpreter comparisons (
E=17,lmax=1/3/6,Cf=32, two gated layers, alpha enabled) enter fusion, agree bitwise with the relay, and preserve caller inputs. - The existing configuration-lookup test passes.
- CPU control-flow checks confirm the backend registration gap, level-dependent candidate selection, and unexpected-error/coverage behavior described above. Benchmark return values in the selection probe are scripted, not measured.
- Ruff passes for all four changed files, and the diff whitespace check passes.
- No GPU, full CUDA freeze, Inductor execution, or performance/test-runtime measurement was used in this review. No new numerical defect was established within the checked kernel cases.

The fallback-test finding from my earlier review is resolved at 2e8e6f3: the tests now set Triton inference level 2, register winning table entries, and assert fused-launch counts. The old request to enable DP_STACK_BWD_FUSED_INFER no longer applies because dispatch now uses the existing level and tuned table.
Motivation
Each gated layer of the mixing-stack backward runs as a three-kernel relay: recompute the gate sigmoids, pointwise backward writing the pre-activation gradient
gz, then the transposed-weight GEMM readinggzback. At the SeZM N=4096 eval workload (E ~ 646k, Cf = 32, lmax = 3) the relay materializes two surfaces per stack and walks them through HBM every gated layer:sig(F, E, L*Cf)fp32, ~0.5 GB, written by the recompute kernel and read straight back by the pointwise kernel;gz(F, E, ROW), ~1.65 GB, written by the pointwise kernel and read straight back by the GEMM.Change
Opt-in via
DP_STACK_BWD_FUSED_INFER(default OFF, read when the backward traversal runs viause_stack_bwd_fused(), matching the repository's convention of construction/call-time reads for these switches). When enabled, and in the supported regime — fp32,Cf < GATE_BMM_MIN_FOCUS_DIM(no cuBLAS gate path),Cf == BLOCK_Kso one K tile is exactly one row group, no weight gradients, no second-order surfaces, no upstream cotangents, and no higher-order gradient graph being built — a single kernel per layer replaces the relay: each program recomputes its row group's gate sigmoid, forms thegztile in registers with exactly the pointwise kernel's operator sequence, and accumulates the GEMM with exactly the backward GEMM kernel'stl.dotorder, so results match the relay bit-for-bit.The
m = 0block (which carries the full scalar chain) and the|m| = 1stripes launch as two PART passes over disjoint column segments: a shared kernel would push the light segment onto the heavy one's register profile (BLOCK_M=64/BN=64 spills 226 slots; the shipped 32/64 config stays in budget).Outside the regime the dispatch falls back to the existing relay unchanged. The fused kernel registers no next-derivative formula;
create_graph=True(e.g. force-loss training) keeps the operator that carries the hand-derived second order — the official backward already routes those differentiations structurally, andnot torch.is_grad_enabled()at the dispatch is a second belt.Measurements
