Summary

Adds offload="cpu" to fit and forward of KumoTabular, TabFM and TabICLv2, which keeps the per-cell token table of the row embedding in pinned host memory and streams it through the GPU in chunks. For tables with many rows, this table is then bounded by host memory instead of GPU memory, while the GPU-only path keeps the previous speed and memory.

sdm.models.set_pinned_register_threads() # optional, use multiple threads for faster pinning
model.fit(x_context, y_context, offload="cpu")
model.predict(x_query)

Description of the change

  • Public API. ICLModel.fit and ICLModel.forward take offload: Literal["cpu"] | None = None, and models opt in through the supports_offload class flag (true for KumoTabular, TabFM and TabICLv2). Offloading requires CUDA inputs, disabled gradients, estimator_batch_size=1, and no more target classes than the model predicts natively. predict replays the fitted cache and currently does not offload.
  • Token buffer. A new internal TokenBuffer holds the R × T × D token table of a row embedding and runs two kinds of in-place passes: row passes update rows independently, and column passes update token columns independently. Without offloading, each pass runs on the whole device tensor at once. With offload="cpu", the table lives in pinned host memory, and each pass streams chunks through three device slots, with host-to-device copies, compute and device-to-host copies on separate streams so that they overlap. Copies use cudaMemcpy2DAsync from cuda.bindings, which PyTorch's CUDA wheels already depend on.
  • Initial embeddings in the first pass. The first pass computes each chunk's cell and label embeddings in place, right before the first column computation on it, instead of filling the whole table first, which saves one table store and load when offloading. In TabFM and TabICLv2, this is the first column pass; in KumoTabular, it's pass 0, which accumulates the inducing-point summary for column block 0 (described next).
  • Row-blocked KumoTabular. KumoTabular alternates column blocks, which attend over context rows through inducing points, with row blocks. Its L column and L row passes are fused into L + 1 row passes. Pass i finishes column block i - 1 from the inducing-point summary of the previous pass, runs row block i - 1, and accumulates the inducing-point summary for column block i over the context rows of each chunk. To support this, Attention and TransformerBlock in sdm.nn gain private partial and finish methods that split attention into a mergeable partial result and the output projection, and InducedTransformerBlock gains summarize and induced_key_value. With the in-place initial embedding and fused column & row processing (KumoTabular), table copies per offloaded fit go from 24 to 12 for KumoTabular, 8 to 6 for TabFM, and 4 to 2 for TabICLv2.
  • Column-major storage. The buffer is stored as [..., T, R, D] (token columns outermost), and row passes see [..., R, T, D] views. The main reason is copy granularity, in preparation for an SSD backend. A chunk of N token columns becomes one contiguous block, and a chunk of N rows becomes T pieces of N × D elements, where N is in the thousands at the default slot size. With row-major storage, a chunk of N token columns was R strided pieces of N × D elements, and N shrinks to a few tokens as R grows. For example, one token is 512 bytes with D = 256 channels in float16, as in KumoTabular and TabFM.
  • Attention chunking. TransformerBlock chunks now align with batch dimensions: inner batch dimensions are taken whole, and one outer dimension is sliced. Every chunk is a view, which removes the gather and the index_put scatter on non-contiguous outputs. Related changes: Linear(out=) handles outputs whose leading dimensions can't be merged, and TabFM applies its row norm in storage order to avoid RMSNorm copies of strided input.
  • Pinned allocation. Large pinned allocations skip power-of-two rounding, using main's existing rounding threshold. PyTorch pins host memory from a single thread by default. Pinning from several threads reduces the allocation time of large pinned buffers, which users can enable in any of three ways: the new sdm.models.set_pinned_register_threads() helper (8 threads by default, as PyTorch recommends, and requires PyTorch 2.14 or newer), the PYTORCH_ALLOC_CONF=pinned_use_cuda_host_register:True,pinned_num_register_threads:8 environment variable set before the process starts, or the private torch._C._accelerator_setAllocatorSettings call. Pinned host memory is released at the end of each offloaded call.

Validation

Usable GPU memory is capped at 32 GiB in all runs below, and pinned memory is allocated and released with 8 registration threads.

  • GPU-only path: 0.4–1.8% faster than main, with the same device and host peaks. Every predicted class probability is exactly the same as main's, except TabFM with 1 estimator, where every query's class probabilities shift by the same 2.2e-4, with no change in predicted classes. The shift appears with the column-major layout, which likely leads to different matrix multiplication kernels that sum in a different order; since float16 addition is not associative, the results round differently.
  • Offload accuracy: TabFM predictions match the GPU-only path exactly. KumoTabular differs from main by at most 0.025 in probability (mean 1.4e-3) with 1 estimator and 0.0084 with 8 estimators, from float16 rounding when merging per-chunk inducing-point attention. TabICLv2 differs by at most 0.045 (mean 2.4e-3) with 1 estimator and 0.020 with 8 estimators, the same float16 chunking noise as the GPU-only path shows when only SDM_CHUNK_MEMORY_FRACTION changes. Both flip 0.08–0.22% of predicted classes.

Offload overhead

Offload overhead over this PR's GPU-only path, measured in instrumented offload runs at the sizes above and split into pinning the host table plus releasing it at the end of fit, and the rest. The remaining overhead is also shown relative to the GPU-only fit time.

Model Estimators Offload overhead Pinned allocation + release Remaining
KumoTabular 1 4.60 s 3.87 s 0.73 s (+6.7%)
KumoTabular 8 9.07 s 3.86 s 5.21 s (+6.0%)
TabICLv2 1 2.71 s 2.64 s 0.07 s (+1.2%)
TabICLv2 8 3.73 s 2.58 s 1.15 s (+2.6%)
TabFM 1 0.72 s 0.64 s 0.09 s (+3.0%)
TabFM 8 0.82 s 0.62 s 0.20 s (+0.9%)
  • Pinning and release: both happen once per fit, since later estimators reuse the pinned block, so the relative overhead shrinks with more estimators.
  • Remaining overhead: it's in the streaming passes. Each pass waits for its first chunk's host-to-device copy before computing, and the next pass waits for the last chunk's device-to-host copy, while the copies of all other chunks overlap with compute. Per estimator, these first loads and last stores account for most of the remainder for TabFM (0.06 s of 0.09 s) and TabICLv2 (0.02 s of 0.04 s). For KumoTabular, they account for 0.12 s of 0.63 s; the rest comes from its 25-chunk passes computing slower than a single device pass while copies run alongside.

Offload beyond GPU memory

With 1 estimator, offload runs context sizes whose token table alone exceeds the 32 GiB GPU cap. Each model uses the largest context-row count that this system can run.

Model Context rows Fit Predict Token table (host) Host peak Device peak, fit Device peak, predict
KumoTabular 170k 41.56 s 0.62 s 40.9 GiB 41.9 GiB 7.1 GiB 6.9 GiB
TabICLv2 340k 31.79 s 0.30 s 40.9 GiB 41.9 GiB 13.2 GiB 10.8 GiB
TabFM 75k 21.77 s 0.93 s 18.2 GiB 19.1 GiB 28.1 GiB 29.1 GiB
  • KumoTabular and TabICLv2: this system's host memory is the limit. It has 62 GiB of RAM, of which about 45 GiB was available, and pinned memory can't be swapped out. On a typical system with significantly more host memory than GPU memory, both can therefore run much larger contexts within the same GPU memory.
  • TabFM: device memory is still the limit. With 1 estimator, its fitted cache stays on the GPU and takes 192 KiB per context row, from 24 ICL layers that each cache a key and a value of 8 readout tokens × 256 channels per row. This cache raises the device peak of offloaded fit and of predict, which replays it and doesn't offload. At 78k rows, predict runs out of memory, so more host memory alone wouldn't help. The next step is to offload the fitted cache to host memory and stream it through the GPU in predict, which would let TabFM run workloads that exceed GPU memory capacity as well.

Tests

pytest test passes on a GPU (1640 passed, 70 skipped), including the new test/models/test_offload.py.

Additional details - **Hardware:** NVIDIA RTX PRO 6000 Blackwell (95 GiB, PCIe Gen5 x16), with usable memory capped through `torch.cuda.set_per_process_memory_fraction`, which also scales SDM's chunk sizes. AMD Ryzen Threadripper PRO 7965WX (24 cores, 48 threads), 62 GiB host RAM with about 45 GiB available. - **Software:** PyTorch 2.14.1+cu132, `cuda-bindings` 13.4.4. - **Data:** synthetic, generated on the GPU from `torch.Generator("cuda").manual_seed(0)`. The features are `torch.randn(R + 4000, 500)`, 500 numerical columns. The binary target is the argmax of `features @ torch.randn(500, 2)`. The first `R` rows are the context and the last 4,000 rows are the queries. The default recipes keep all 500 columns: none are constant, and the 500-column cap of KumoTabular and TabFM isn't exceeded. - **Models:** - `KumoTabular(task="classification", size="large")` with `nvidia/Kumo-Tabular` revision `v1.0.1`. - `TabICLv2(task="classification")` with `tabicl-classifier-v2-20260212.ckpt`. - `TabFM(task="classification", pretrained=False)` with random weights after `torch.manual_seed(0)`, because the pretrained weights require accepting a non-commercial license. - **Calls:** under `torch.autocast("cuda", torch.float16)`: `model.fit(x=x_context, y=y_context, num_estimators=E, generator=torch.Generator("cuda").manual_seed(0))`, plus `offload="cpu"` for the offload variant, then `model.predict(x_query)`. Default recipes and `estimator_batch_size=1`. - **Measurement:** each run is a fresh process with one `fit` and one `predict`, so offload includes its one-time pinning cost. Every run, including main, set `PYTORCH_ALLOC_CONF=pinned_use_cuda_host_register:True,pinned_num_register_threads:8` before the process started, which is what `sdm.models.set_pinned_register_threads()` applies by default. Times are wall-clock between `torch.cuda.synchronize()` calls, and each entry is the mean of 2 runs unless noted. The device peak is `torch.cuda.max_memory_allocated()`. The host peak is the process's `VmHWM` minus its `VmRSS` before `fit`. Main was imported from an exported copy of 30564cd through `PYTHONPATH`. - **Overhead breakdown:** measured in separate instrumented offload runs, 2 per case, that synchronize around the pinned allocation of the host table, the release of pinned memory, and each pass. The overhead is the instrumented fit time minus the GPU-only fit time from the first table. First loads and last stores are timed with CUDA events on the copy streams. Per-pass differences come from one instrumented run per model with and without offload. Within each pair of runs, pinned allocation, release and the per-pass differences add up to the measured fit overhead within 0.02 s. - **Host memory with several estimators:** `fit` keeps every estimator's cache in pinned host memory, as on main. Per estimator, that's the ICL key/value cache, which grows with context rows, plus fixed-size column-layer caches over inducing points: 12 KB/row plus 0.73 GiB for KumoTabular, 24 KB/row plus 0.09 GiB for TabICLv2, and 192 KiB/row plus 0.75 GiB for TabFM. TabFM's per-row cost comes from its 24 ICL layers, each caching a key and a value of 8 readout tokens × 256 channels per row. - **Copy bandwidth:** pinned memory reaches 56 GB/s in both chunk patterns. Pageable memory reaches only 16–20 GB/s and blocks the host thread for the whole copy. - **Threaded registration:** on this system, pinning 15.5 GB took 5.9 s with 1 thread and 1.9 s with 16 threads, with no gain beyond 16. Freeing went from 2.1 s to 1.0 s. - **Row-major storage:** tried with the fused passes and gave no gain. Row-chunk copies got faster, but compute on the row-major layout got slower by about the same amount. - **Possible follow-ups:** offload the fitted cache, starting with TabFM; reuse pinned memory across `fit` calls; keep part of the table on the device; an SSD backend; offload with estimator batching or class decomposition; TabICLv2's `train_mask`.

Changes: CPU Offload and Chunked Execution

Layer / File(s) Summary
Pinned storage and token streaming
pyproject.toml, sdm/_memory.py, sdm/_token_buffer.py, sdm/models/base/__init__.py, sdm/models/__init__.py, docs/source/api/models.rst
Adds pinned-memory registration settings and TokenBuffer for device-resident or pinned-CPU storage. The buffer streams row and column chunks and supports column-layer cache operations. Exports and API documentation include set_pinned_register_threads.
Partial attention and batch chunking
sdm/nn/attention.py, sdm/nn/linear.py, sdm/nn/set_transformer.py, test/nn/test_set_transformer.py
Adds partial attention summaries and finish methods. Attention chunking indexes batch dimensions directly and assembles caches in broadcast batch shape. Linear.forward recursively processes slices when checked output strides are non-contiguous. Tests compare incremental summaries with full-pass projections.
Offload validation and model routing
sdm/models/base/icl.py, sdm/models/kumo/tabular/model.py, sdm/models/tabfm/model.py, sdm/models/tabiclv2/model.py
Adds the offload option to the base model API, validates model support and CUDA input, and passes the setting through supported model implementations. forward and fit release pinned host allocator cache in a finally block when offload is enabled.
Embedding paths and offload validation
sdm/models/kumo/tabular/cell_embedding.py, sdm/models/kumo/tabular/row_embedding.py, sdm/models/tabfm/cell_embedding.py, sdm/models/tabfm/row_embedding.py, sdm/models/tabiclv2/row_embedding.py, test/models/tabiclv2/test_model.py, test/models/test_offload.py
The three row embedding implementations use separate gradient-enabled and no-gradient execution paths. Their no-gradient paths use TokenBuffer; offloading with gradients is rejected. Cell embedding adds column selection, and Kumo Tabular adds cached mean imputation. Tests compare offloaded and regular outputs and check unsupported inputs and configurations.

Declare the package that provides cuda.bindings. Import it before pinned allocation.

TokenBuffer._stream imports cuda.bindings.runtime only when rows or columns starts streaming. The project metadata does not declare this package. In a valid CUDA environment that lacks it, offload="cpu" can fail with ModuleNotFoundError after pinned host storage and device slots are allocated.

Declare the package as an optional offload dependency, or document it on offload. Import it during offload initialization and reuse the stored module:

Use zip(..., strict=True) in the per-slice recursion.

If input.size(0) != out.size(0), plain zip stops at the shorter tensor. The remaining out slices are then never written, and no error is raised. This can happen with a broadcast leading dimension of size 1 in input. The bmm path below fails on such a mismatch at view, so the new branch changes a clear error into silently uninitialized output. Current callers pass matching leading dimensions. Examples are tokens[..., K:, :] in TokenBuffer slots and nan_lin(missing). The coding guidelines allow a runtime check where a bad value "could otherwise be silently accepted with wrong semantics".

Add autocast-dtype and regression coverage for the offload path.

The parity tests run only in float32 and only for classification. The changed code has untested branches:

  • TokenBuffer dtype: every row embedding uses torch.get_autocast_dtype(...) when autocast is enabled. A float16/bfloat16 buffer changes _pitch, the slot byte arithmetic, and slot.view(self.dtype). The PR also reports TabICLv2 offload divergence under float16.
  • Regression: KumoTabular._forward and TabICLv2._forward now pass offload on the Task.regression branch. y_lin and y_mlp feed add_labels there. No test calls these paths.
  • Uncached ICLModel.forward(..., offload="cpu") at model level: only fit and predict are tested.

The path instructions ask for "parametrization covers relevant dtype/device variants".

Document that the offload path changes process-wide pinned-allocator settings.

TokenBuffer.__init__ calls this helper at sdm/_token_buffer.py Line 79 on every offloaded call. The helper sets pinned_use_cuda_host_register:True and a register thread count. It does not restore the previous values. After one offload="cpu" call, every later pinned allocation in the user's process follows these settings. This includes DataLoader(pin_memory=True) buffers and other libraries. set_pinned_max_round_threshold(mb=1) has the same effect. Each force=False early return protects settings that already exist. It does not protect the allocator defaults.

Use one of these options:

  • State this side effect in the offload docs in ICLModel.forward and ICLModel.fit.
  • Save and restore the allocator settings around the offloaded call.

Pass offload only when it is set.

forward and fit currently pass offload=None to _forward implementations. This violates the _forward contract, which states that offload is only passed to models with supports_offload. It can also expose an unexpected keyword to implementations that do not accept it. Keep the cached kwargs unchanged so predict continues without offloading.

Suggested fix

+ if offload is not None:
+            kwargs["offload"] = offload
         try:
             outs = self._forward_members(
                 contexts=contexts,
                 queries=queries,
                 estimator_batch_size=estimator_batch_size,
                 callbacks=callbacks,
                 generator=generator,
-                offload=offload,
                 **kwargs,
             )

In fit, build a local copy of kwargs, add offload to that copy only when it is not None, and pass the copy to self._forward. Keep cache["kwargs"] backed by the original kwargs.

Guard the flash branch by CUDA compute capability.

The flash condition checks dtype and head dimension, but not the GPU architecture. FlashAttention requires sm80 or newer. On pre-Ampere GPUs, such as T4 or V100, fp16 inputs can reach the raw _scaled_dot_product_flash_attention op. Depending on the PyTorch version, that call can raise. F.scaled_dot_product_attention avoids this by choosing another backend. The direct op call does not.

Add a capability check so pre-Ampere GPUs use the efficient-attention path:

         and query.size(-1) % 8 == 0
         and query.size(-1) <= 256

Use the tensor method instead of the function.

Add device-independent tests for summarize and induced_key_value.

The docstring promises that chunked summarize followed by induced_key_value matches a single forward pass, up to rounding. The supplied tests cover this only through test/models/test_offload.py::test_row_embedding_offload. That test is @onlyCUDA and goes through the full row-embedding pipeline. These paths therefore have no CPU test coverage and no isolated test:

  • the CPU branch of _attention_with_lse;
  • the log-add-exp merge;
  • the multi-dimensional _batch_chunks indexing in TransformerBlock.partial.

Add a plain pytest function with these properties:

  • It builds an InducedTransformerBlock with a small TransformerBlock.
  • It splits a random key_value into uneven chunks and calls summarize on each.
  • It compares induced_key_value(summary) with the return_key_value=True output of forward.
  • It runs with torch.no_grad() and parametrizes over batch_size_limit values such as None and 1, to exercise the chunking.
  • It runs with at least a 2-D batch shape.

As per path instructions: "Check that behavior changes in sdm/ have corresponding test coverage ... parametrization covers relevant dtype/device variants."

Expand grouped key/value heads before CPU partial attention.

When num_key_value_heads < num_query_heads, SDPA.partial passes unequal head counts to the CPU flash kernel. In PyTorch 2.7, the kernel indexes key/value data by query-head index. It can read the wrong head or access data outside the key/value tensor.

Expand the heads before the CPU call and add a grouped-head summary test. The current summary test uses equal head counts.

Use keyword arguments in the new CUDA attention calls.

Both calls span multiple lines. The _scaled_dot_product_efficient_attention call passes None, True positionally, so a reader cannot tell which argument is attn_bias and which is compute_log_sumexp. The torch.ops.aten overloads accept the schema argument names as keywords.

Update the multi-line calls to `_scaled_dot_product_flash_attention` and
`_scaled_dot_product_efficient_attention` to pass their arguments by keyword,
including naming the efficient attention call’s `attn_bias` and
`compute_log_sumexp` arguments. Preserve the existing values and behavior.

test/nn/test_set_transformer.py: 1

67-67: Trivial · Maintainability & Code Quality · Quick win

Add dtype coverage so the new kernel dispatch in _attention_with_lse gets tested.

This test only runs in float32 with 4 channels per head (channels=8, num_query_heads=2). On CUDA, float32 always takes the _scaled_dot_product_efficient_attention branch. The flash-attention branch in _attention_with_lse needs float16 or bfloat16, a head dimension divisible by 8, and compute capability 8 or higher. The test never reaches that branch.

Parametrize the test over dtype (torch.float32, torch.bfloat16). Use channels=16 so each head has 8 channels. Loosen the tolerances for the reduced-precision cases.

As per path instructions, "parametrization covers relevant dtype/device variants".

Expand the test covering _attention_with_lse to run with torch.float32 and
torch.bfloat16, and set channels to 16 so each query head has the required
8-channel dimension. Ensure the test inputs use the selected dtype, and loosen
comparison tolerances for reduced-precision cases while preserving the existing
float32 expectations.
